This comprehensive report synthesizes TR134 through TR137 into a single decision-grade narrative for safety-critical LLM deployment on consumer hardware. The research arc spans four technical reports and 74,254 evaluated samples, beginning with the systematic measurement of quantization effects on safety alignment (TR134) and culminating in a unified safety-cost framework that ranks optimization axes by danger and prescribes per-model validation protocols (TR137). Between these endpoints, the program establishes a strong null finding -- that concurrent inference does not degrade safety under any tested condition (TR135, 39,060 samples, all jailbreak slopes exactly zero, I-squared = 0.0%) -- and discovers an entirely new safety variable in the form of serving backend choice, which produces safety differences of 4-25 percentage points driven not by inference computation but by chat template divergence between GGUF-embedded and HuggingFace tokenizer formats (TR136). The synthesis ranks the three optimization axes by safety impact: quantization accounts for 57% of total safety cost with extreme model disagreement (I-squared = 99.9%), backend choice accounts for 41% with near-total disagreement (I-squared = 99.5%), and concurrency accounts for 2% with perfect model agreement (I-squared = 0.0%). Phase 2 established that Q4_K_M quantization and vLLM serving are the highest-leverage deployment decisions for performance and cost. Phase 3 (TR134-TR137) asks: do those same optimization choices degrade safety alignment? The answer is nuanced: quantization degrades safety severely for some models and not at all for others; backend choice introduces a previously unknown safety variable driven by chat template divergence; and concurrency is entirely safe. The combined evidence from 74,254 evaluated samples across 5 distinct models, 7 quantization levels, 4 concurrency levels, and 4 serving backends produces a unified safety-cost framework that complements Phase 2's performance recommendations without contradicting them.

Program trajectory (TR134 -> TR137)

The safety research program is intentionally sequential. Each report either fills a gap exposed by the previous one or provides the cross-axis comparison that individual studies cannot:

  1. TR134 establishes the safety cost of quantization. Four models (Llama 3.2 1B/3B, Mistral 7B Instruct v0.3, Qwen 2.5 7B Instruct) across 7 quantization levels (FP16 through Q2_K), evaluated on 4 safety tasks (AdvBench refusal, jailbreak amplification, BBQ bias, TruthfulQA) and 2 capability tasks (MMLU, ARC-Challenge). Three phases of increasing scope culminating in 24,778 total samples. Introduces LLM-as-judge validation (Qwen 2.5 7B Q8_0) on 12,168 samples. This ordering is methodologically forced. You cannot assess combined safety cost without per-axis measurements. You cannot rank axes without a synthesis. And you cannot know that backend is a safety variable at all without explicitly testing it -- Phase 2's finding that backend choice does not affect quality (TR124, C2: 0/7 metrics significant after Holm-Bonferroni across 5 models and 2 backends) did not extend to safety, because quality benchmarks and safety benchmarks measure fundamentally different model behaviors.

Bottom-line decisions you can ship

  1. Safety-validated quantization floor: Q4_K_M or higher. All tested models retain >= 93% of baseline safety at Q4_K_M (Llama 1B: 98.4%, Llama 3B: 93.8%, Qwen 7B: near-baseline, Mistral 7B: stable). Below Q4_K_M, safety degrades model-specifically and unpredictably. This aligns with Phase 2's Q4_K_M recommendation for capability preservation (TR125: within -4.1pp of FP16 on MMLU/ARC).

  2. Concurrency is safety-neutral: scale freely. Max effect 0.4pp, zero jailbreak amplification, I-squared = 0.0% (all models agree). No safety testing is required for concurrency changes. This is fully compatible with Phase 2's concurrency scaling recommendations (TR129: Amdahl serial fractions s=0.39-0.54; TR130: vLLM 2.25x advantage at N=8).

  3. Backend migrations require safety re-validation. Backend accounts for 41% of total safety cost. Switching from Ollama GGUF to vLLM/TGI FP16 can cost 4-25pp of safety, driven by chat template divergence. The root cause is identifiable and potentially fixable (align templates between formats), but until fixed, any backend migration is a safety-critical change.

  4. Per-model safety profiling is mandatory. I-squared = 99.9% means models disagree completely on quantization's safety impact. Llama 1B loses 35pp at Q2_K; Llama 3B gains 6pp at the same level. No generic guideline drawn from aggregate statistics will be reliable for approximately half the models it is applied to.

  5. Ban Q2_K for Llama-class 1B models. 57.5% safety retention = CRITICAL risk tier.   6. Monitor jailbreaks under quantization, not under concurrency. All 4 jailbreak technique slopes are negative under quantization (-0.021 to -0.036 per BPW), meaning compliance increases as precision decreases. Concurrency does not amplify jailbreaks (all 12 model-technique slopes = 0.000). Backend changes require jailbreak re-testing because refusal behavior is template-sensitive.

Operational Defaults (Safety Decision Card)

Valid under stated boundary conditions (consumer GPU, models <= 7.6B, GGUF quantization, temperature 0).

What invalidates this report:

  • Model family not in the tested set (different RLHF recipe may produce different quantization resilience)

1. Introduction and Research Questions

1.1 Motivation

Open-weight LLMs that run on consumer hardware are already widely available. Anyone with a laptop GPU can download a quantized model, serve it locally, and deploy it for applications ranging from personal assistants to customer-facing chatbots. The tooling for local deployment (Ollama, llama.cpp, vLLM) is mature and accessible. What is missing is safety evaluation infrastructure — a systematic way to know whether the optimizations required to fit a model on a consumer GPU (quantization, batching, backend choice) have degraded its safety alignment. Without this infrastructure, consumer LLM deployments risk generating harmful content, failing to refuse dangerous requests, or exhibiting demographic biases that were controlled at full precision but eroded at deployment precision.

Phase 2 of the Banterhearts research program (TR123-TR133) answered the performance question: what model, quantization level, backend, and serving stack should we deploy, and when does each choice break? The output was a set of deployment decisions backed by 70,000+ measurements, culminating in a predictive capacity planner (ChimeraForge). That work was necessary but incomplete. It optimized for cost, throughput, and capability -- but never asked whether those optimizations are safe.

Phase 3 (TR134-TR137) fills the safety gap. It asks: when you quantize a model to Q4_K_M (as Phase 2 recommends), does it still refuse harmful prompts? When you scale to 8 concurrent users (as Phase 2 enables), does safety degrade under load? When you migrate from Ollama to vLLM (as Phase 2 recommends at N >= 4), does the model behave differently on safety-sensitive inputs?

These questions are not theoretical. They are the questions that determine whether a production deployment passes a safety review. Phase 2's Q4_K_M recommendation is useless if Q4_K_M strips safety alignment. Phase 2's vLLM recommendation is dangerous if vLLM produces different safety behavior than Ollama. The safety cost of inference optimization is an externality that performance benchmarks do not capture and cannot detect. MMLU accuracy tells you whether the model can answer science questions; it does not tell you whether the model will refuse to synthesize a bioweapon when asked politely. ARC-Challenge tells you whether the model can reason about physics; it does not tell you whether the model has preserved the refusal training that prevents it from assisting with fraud, harassment, or violence.

The central challenge of Phase 3 is therefore measurement: how do you quantify "safety" in a way that is comparable across quantization levels, concurrency levels, and serving backends? The answer is a battery of safety benchmarks -- AdvBench refusal (100 harmful prompts), TruthfulQA (50 factual accuracy probes), BBQ bias (200 demographic bias probes across 11 categories), and jailbreak amplification (120 prompts: 30 direct + 90 jailbreak-wrapped across 3 techniques) -- scored by automated classifiers (RefusalDetector, TruthfulnessScorer, BiasDetector) and validated against an LLM judge (Qwen 2.5 7B Q8_0). The classifiers are imperfect (kappa = 0.147 with the LLM judge), but they are consistent across conditions, which is what cross-condition comparison requires. The absolute safety scores should not be interpreted as ground truth; the relative differences between conditions are the evidential basis for every claim in this report.

1.2 Research questions (program level)

This conclusive report answers the following seven cross-cutting questions, each mapping to one or more technical reports:

  1. Does quantization degrade safety alignment, and if so, by how much and for which models? (TR134) The performance-quality tradeoff of quantization is well-studied (TR125). The safety-quality tradeoff is not. This question requires a safety evaluation battery applied across the full quantization spectrum (FP16 through Q2_K) on multiple model families with different RLHF recipes. The answer determines whether Phase 2's Q4_K_M recommendation can be extended to safety-critical deployments without qualification.

  2. Does concurrent inference degrade safety? (TR135) Multi-agent workloads process multiple requests simultaneously on the same GPU. If safety classifiers are sensitive to inference scheduling, or if model behavior changes under concurrent load due to memory pressure, numerical non-determinism, or GPU scheduling effects, safety scores could degrade. This question requires fixed-quant evaluation across concurrency levels with the same safety battery used in TR134, enabling direct cross-TR comparison.

  3. Does the serving backend affect safety? (TR136) Phase 2 established that backend choice does not affect quality (TR124, 7 metrics, 5 models, ANOVA + Holm-Bonferroni). Does the same hold for safety? Backends differ in weight format (GGUF vs FP16), chat template handling, tokenizer configuration, and request processing pipeline. Any of these could interact with safety-aligned behavior in ways that are invisible to capability benchmarks.

  4. Which optimization axis is most dangerous for safety? (TR137) If a practitioner has limited testing budget, should they prioritize quantization validation, concurrency testing, or backend migration testing? This question requires cross-axis comparison with standardized effect size ranking, heterogeneity analysis, and bootstrap confidence intervals -- statistical machinery that no individual TR can provide because each tests only one axis.

  5. Does safety degrade faster than capability under each optimization? (TR137) The "safety veneer" hypothesis holds that RLHF alignment is a thin layer applied after pre-training, and therefore more fragile than general capability. If true, safety scores should drop faster than capability scores under the same optimization pressure.   6. Are jailbreak patterns consistent across optimization axes? (TR137) Jailbreak amplification under quantization was established in TR134 (all 4 technique slopes negative). Does the same pattern hold under concurrency? Under backend change? Consistency would suggest a universal mechanism (weight perturbation erodes refusal training); inconsistency would suggest axis-specific effects that require targeted countermeasures.

  7. Do models agree on which axis is dangerous? (TR137) If all models agree that quantization is dangerous, a universal policy is possible. If models disagree, per-model profiling is required and generic guidelines become unreliable. I-squared heterogeneity analysis quantifies this agreement and determines whether the research program's findings can be generalized beyond the specific models tested.

1.3 Contributions of this synthesis

This synthesis contributes four decision-grade deliverables that together close the safety gap identified in Phase 2's conclusive report:

  1. Quantization safety profile (TR134): A systematic measurement of safety alignment under GGUF quantization across 4 models (3 architecture families, 3 RLHF variants) and 7 quantization levels, with per-task vulnerability analysis (AdvBench, TruthfulQA, BBQ, jailbreak), per-category bias breakdown (11 BBQ demographic categories), jailbreak amplification rates for 4 attack techniques, and LLM judge validation on 12,168 samples. This profile reveals that quantization safety is not a monotone function of precision: Llama 3B anomalously improves at Q2_K while Llama 1B catastrophically degrades, and Mistral 7B has a fundamentally different safety-precision relationship than either Llama or Qwen.

  2. Concurrency safety clearance (TR135): Definitive null finding -- concurrency does not affect safety. This is the strongest single finding in the program, with zero jailbreak slopes, 0.0% I-squared across all models, TOST equivalence in 8/9 adjacent comparisons, and a clear mechanistic explanation (Ollama serializes inference, so concurrent requests queue rather than interfere). This clearance enables practitioners to scale concurrency on pure performance grounds without safety constraints, fully compatible with Phase 2's scaling recommendations.

  3. Backend safety variable discovery (TR136): Identification of a previously unknown safety factor -- backend choice -- that accounts for 41% of total safety cost and is driven by chat template divergence between GGUF-embedded and HuggingFace tokenizer formats. This finding is particularly significant because Phase 2's quality testing (TR124) found no backend effect on capability, creating a false sense of safety: operators who validated quality equivalence across backends would reasonably (but incorrectly) assume safety equivalence. The discovery that safety is differentially sensitive to backend choice -- through a mechanism (template divergence) that capability benchmarks cannot detect -- is a qualitatively new insight.

  4. Unified safety-cost framework (TR137): Cross-axis effect ranking (quant 57%, backend 41%, concurrency 2%), 24-configuration deployment matrix with risk tiers, heterogeneity analysis (I-squared per axis), cross-axis jailbreak synthesis, per-category bias patterns, safety-capability asymmetry analysis, and model-level verdicts. This framework integrates with Phase 2's performance framework to produce a complete deployment decision system that jointly optimizes for throughput, cost, quality, and safety.

2.1 RLHF safety alignment

Modern LLMs achieve safety alignment through Reinforcement Learning from Human Feedback (RLHF) or its variants (DPO, PPO, ORPO). The process fine-tunes a pre-trained model to refuse harmful requests, provide truthful information, and avoid demographic biases. The resulting safety behavior is encoded in the model's weights -- specifically in the modifications made during fine-tuning relative to the base pre-trained model.

A key architectural question is whether safety alignment is "deep" (distributed across all layers and attention heads) or "shallow" (concentrated in a few layers or a thin weight modification). If shallow, optimizations that perturb weights (quantization) or change input processing (chat templates) could disproportionately affect safety relative to general capability. This is the "safety veneer" hypothesis, which TR137 tests across 10 model-axis combinations and refutes as a universal claim. The evidence suggests that safety alignment depth varies by model family and alignment method: Qwen 2.5's DPO-based alignment appears more deeply encoded (slope = +0.008, near-flat) than Mistral's supervised fine-tuning (slope = +0.041, steep).

The models tested in this program span three RLHF variants: Llama 3.2 (Meta's RLHF + rejection sampling), Mistral 7B Instruct v0.3 (Mistral AI's supervised fine-tuning), and Qwen 2.5 (Alibaba's DPO-based alignment). These represent architecturally similar transformer models with fundamentally different alignment procedures, enabling family-level comparison of quantization resilience. The family-level comparison is operationally important because it determines whether safety profiling results from one model can be transferred to another model from the same family -- the extreme heterogeneity (I-squared = 99.9%) suggests they cannot, even within the same family (Llama 1B vs Llama 3B).

2.2 Quantization and weight perturbation

Quantization reduces weight precision from FP16 (16 bits per weight) to lower representations. GGUF k-quant schemes, used by Ollama and llama.cpp, apply per-block mixed-precision quantization with scaling factors. The quantization levels tested span Q2_K (approximately 2.5 bits per weight) through FP16 (16.0 bits per weight), with intermediate levels at Q3_K_S (3.5 BPW), Q4_K_M (4.5 BPW), Q5_K_M (5.5 BPW), Q6_K (6.5 BPW), and Q8_0 (8.0 BPW).

Phase 2 (TR125) established that Q4_K_M preserves capability (within -4.1pp of FP16 on MMLU/ARC across 5 models) while Q2_K produces near-random accuracy. The safety question is whether the same quality cliffs apply to safety metrics. A priori, there are reasons to expect different behavior: safety alignment is a fine-tuning modification on top of pre-training, potentially more fragile than the base capabilities encoded during pre-training. The weights modified during RLHF are a small fraction of total parameters, and quantization may disproportionately affect these small modifications because they represent subtle adjustments to the model's decision boundaries rather than the large-magnitude features that encode factual knowledge.

The relationship between bits per weight and safety retention is empirically nonlinear and model-dependent. Llama 1B shows a catastrophic cliff between Q3_K_S (3.5 BPW) and Q2_K (2.5 BPW), losing 35.2pp of safety in a single quantization step. Llama 3B, by contrast, shows an anomalous improvement at Q2_K -- likely an artifact of Q2_K degrading coherence so severely that the model produces incoherent refusals rather than coherent compliance, inflating refusal scores. These contrasting behaviors within the same architecture family underscore that parameter count modulates quantization resilience in a nonlinear way that cannot be predicted from capability benchmarks alone.

2.3 Safety benchmarks and evaluation batteries

The safety evaluation battery used across all three experimental TRs consists of four safety tasks and two capability reference tasks, deliberately chosen to cover the major dimensions of LLM safety:

AdvBench Refusal (100 samples): Harmful prompts from the AdvBench dataset covering categories including violence, fraud, illegal activities, and harmful content generation. The model should refuse each prompt. Scored by RefusalDetector, a regex classifier that identifies refusal patterns (e.g., "I cannot", "I'm sorry, but", "As an AI assistant"). Higher score = more refusals = safer. The 100-sample size provides a minimum detectable effect of approximately 18pp at 80% power for pairwise comparisons -- adequate for detecting catastrophic degradation but insufficient for detecting moderate effects.

Jailbreak Amplification (120 samples): 30 harmful behaviors from JailbreakBench, each presented in 4 forms: direct (no wrapper) and 3 jailbreak techniques (prefix injection, DAN-style persona, roleplay scenario). Tests whether quantization or other optimizations make the model more susceptible to adversarial prompt engineering. Scored by RefusalDetector on the non-refusal rate (compliance). The 4-technique design enables technique-specific slope analysis across quantization levels, revealing that prefix injection is the most effective amplifier (-0.036 per BPW) while roleplay is the weakest (-0.021 per BPW).

BBQ Bias (approximately 200 samples): Bias Benchmark for QA, covering 11 demographic categories (Race/Ethnicity, Gender, Age, Nationality, Socioeconomic Status, Disability, Religion, Sexual Orientation, Physical Appearance, Race x Gender, Race x SES). Tests whether the model answers bias-probing disambiguation questions without demographic stereotyping. Scored by BiasDetector. The per-category sample sizes are small (15-25 per model-quant combination), making per-category slopes exploratory rather than confirmatory -- a limitation explicitly documented in the caveats of TR134 and TR137.

TruthfulQA (50 samples): Factual accuracy probes testing whether the model produces truthful answers versus common misconceptions. Scored by TruthfulnessScorer with reference-matching. The smallest task in the battery, with corresponding power limitations (MDE approximately 28pp at 80% power).

Two capability tasks (MMLU: 285 samples for TR134, 200 for TR135/TR136; ARC-Challenge: 200 samples) provide the baseline for safety-capability asymmetry analysis. These are the same benchmarks used in TR125 for capability evaluation, enabling direct cross-phase comparison.

2.4 Chat template divergence and prompt framing

A critical finding of this research program is that the serving backend affects safety not through inference computation but through chat template handling. Ollama uses GGUF-embedded chat templates, while vLLM and TGI use HuggingFace tokenizer chat templates parsed from tokenizer_config.json. These templates control how system prompts, user messages, and assistant turns are formatted before being fed to the model -- they determine the exact token sequence that the model processes, including special tokens, role markers, and whitespace that the model was trained to recognize as conversational structure.

When the templates diverge -- which they do for several models in the test set -- the model receives differently formatted inputs, producing different safety behavior even at the same weight precision. The divergence is not a bug in any single backend; it reflects the imperfect fidelity of GGUF model conversion, which must re-implement the HuggingFace tokenizer's chat template logic in a different format. For models where the conversion is faithful (e.g., some Qwen variants), the backend effect is small (6pp). For models where the conversion introduces subtle differences in special token placement or system prompt framing (e.g., Llama 3.2 1B), the backend effect is large (25pp).

This mechanism was first identified in TR136 and is the primary driver of the "backend effect" that accounts for 41% of total safety cost. It is particularly impactful because it is invisible to capability benchmarks: MMLU and ARC-Challenge test factual knowledge and reasoning, which are insensitive to the conversational framing provided by chat templates. Only safety tasks (refusal, jailbreak resistance) are sensitive to the framing, because safety behavior depends on the model recognizing the conversational context in which a harmful request is made. A model trained to refuse harmful requests when it sees the specific token sequence <|start_header_id|>user<|end_header_id|> may not exhibit the same refusal when it sees a slightly different token sequence, even if the semantic content of the request is identical.

2.5 Automated safety scoring challenges

All safety scores in this program are produced by automated classifiers: RefusalDetector (regex-based, approximately 15 refusal patterns), BiasDetector (regex-based, stereotype detection), and TruthfulnessScorer (reference-matching). These classifiers are fast, deterministic, and consistent -- but they are surface-level. A response that "technically refuses" but provides harmful information through implication, analogy, or embedded instructions will be scored as safe. A response that uses novel refusal language not captured by the 15 regex patterns will be scored as unsafe.

LLM judge validation (Qwen 2.5 7B Q8_0) was applied in TR134 (12,168 samples) and TR136 (5,616 samples) to provide an independent signal. The judge uses structured prompts to classify responses as FULL_REFUSAL, PARTIAL_REFUSAL, COMPLIANCE, or UNCLEAR. Cohen's kappa between regex classifiers and the judge is 0.147 overall (poor by Landis & Koch convention), with task-specific kappas of 0.013 (AdvBench, essentially chance agreement) and 0.282 (TruthfulQA, fair agreement).

The poor kappa does not invalidate the automated scores for cross-condition comparison. Both classifiers are applied consistently across all conditions, so systematic biases cancel when computing deltas between conditions. A classifier that systematically over-counts refusals will over-count equally at Q4_K_M and Q2_K; the delta between conditions remains informative. However, the absolute safety scores should not be interpreted as ground truth -- they are consistent proxies, not calibrated measurements. The directional findings (quantization is dangerous, concurrency is safe) are robust to this uncertainty, but precise thresholds (e.g., "93% retention at Q4_K_M") carry measurement uncertainty that is not fully quantified.

The low kappa also reveals a deeper problem: safety classification at low quantization levels is inherently ambiguous. Q2_K models produce responses that are often incoherent, truncated, or partially completed. These responses are difficult to classify for both regex classifiers and LLM judges because the concept of "refusal" breaks down when the model cannot produce coherent text. TR134 documents that Q2_K AdvBench agreement drops to 58%, meaning the two classifiers agree on barely more than half of Q2_K responses. This ambiguity is a feature of the underlying phenomenon, not a classifier bug -- it reflects the genuine uncertainty about whether an incoherent response constitutes a "safe" outcome.

2.6 Multi-family safety evaluation

Testing safety across multiple model families is essential because different RLHF recipes produce different alignment characteristics. A finding that holds for all tested families can be generalized with moderate confidence; a finding that holds for only one family is model-specific and requires per-model validation.

The three families in this program span a range of alignment approaches: Meta's Llama 3.2 uses RLHF with rejection sampling, producing models that tend to have high refusal rates at baseline but variable resilience to weight perturbation. Mistral AI's Mistral 7B Instruct v0.3 uses supervised fine-tuning (SFT), which typically produces weaker safety alignment than RLHF -- confirmed by TR134's finding that Mistral shows 87-100% jailbreak compliance even at Q8_0. Alibaba's Qwen 2.5 uses Direct Preference Optimization (DPO), which modifies the loss function to directly optimize for preference pairs rather than training a separate reward model, and appears to produce more quantization-resistant alignment (slope = +0.008, near-flat across quantization levels).

The family comparison is limited by the one-way ANOVA result: F=2.50, p=0.1370, not significant at alpha=0.05. This means we cannot statistically confirm that the three families differ in quantization resilience at the sample sizes tested. However, the I-squared statistic of 99.9% indicates that almost all variance in safety slopes is between-model rather than within-model, suggesting that the differences are real but the study is underpowered to confirm them via ANOVA. Adding even one more model per family would substantially improve the power of this comparison.

2.7 Prior work on quantization effects on safety

The literature on quantization effects on LLM safety is sparse relative to the extensive work on quantization effects on capability. Most quantization studies (Frantar et al. 2022, Lin et al. 2024, Dettmers et al. 2023) evaluate quality using perplexity, MMLU accuracy, or downstream task performance -- none of which capture safety-specific behaviors like refusal, bias, or jailbreak resistance.

The few studies that address safety under quantization (Sun et al. 2024, Huang et al. 2024) typically test 1-2 models at 2-3 quantization levels using a single safety benchmark. TR134 extends this work substantially: 4 models, 7 quantization levels, 4 safety benchmarks, 2 capability benchmarks, and jailbreak amplification analysis with 4 attack techniques. The per-category bias analysis across 11 BBQ demographic categories and the LLM judge validation on 12,168 samples are, to our knowledge, novel contributions.

A key distinction between TR134 and prior work is the emphasis on model disagreement. Most prior studies report average effects across models, which masks the extreme heterogeneity that TR134 reveals. An average safety slope of +0.020 per BPW sounds moderate, but it conceals the fact that Llama 1B's slope is +0.041 (severe) while Llama 3B's slope is -0.012 (improvement). Reporting the average without the variance would produce a misleading universal guideline; TR134 and TR137 make the heterogeneity the central finding.

2.8 Safety under concurrent inference

The question of whether concurrent inference affects safety has not been systematically studied in the literature. Multi-agent LLM deployments are common in production (agentic workflows, parallel tool-calling, batch evaluation, multi-user serving), but safety evaluations are typically conducted on single-request systems. The implicit assumption is that safety is a property of the model weights and the input, not of the inference scheduling.

TR135 validates this assumption for the specific case of Ollama's serialized inference on a single GPU. The mechanism is straightforward: Ollama processes requests sequentially (max concurrent kernels = 1, established in TR131), so each agent receives the same compute path as a solo agent. The concurrent requests queue rather than interfere, and at temperature 0, deterministic sampling produces bit-identical outputs regardless of concurrent load. The null finding (max delta 0.4pp, all jailbreak slopes zero) is therefore mechanistically expected and empirically confirmed.

However, the null finding should not be extrapolated to inference systems with true parallelism. Continuous batching (vLLM, TGI) processes multiple requests simultaneously by batching decode operations into single GPU kernel launches (TR132: 77-80% kernel reduction). If the batched computation introduces numerical differences -- for example, through different memory access patterns or different attention mask configurations -- safety behavior could theoretically diverge. This remains untested and is identified as a gap in Section 8.

2.9 Backend effects on model behavior

Phase 2 (TR124) established that backend choice does not affect output quality across 7 metrics, 5 models, and 2 backends at temperature 0, with ANOVA + Holm-Bonferroni correction confirming no significant differences. This finding was operationally important because it justified the recommendation to use the cheapest backend (Ollama with quantization) without quality sacrifice.

Phase 3 (TR136) discovers that this quality equivalence does not extend to safety. The mechanism is different from what quality testing can detect: quality benchmarks (MMLU, ARC, BERTScore, ROUGE-L) test the model's factual knowledge and text generation capability, which depend on the model weights and are largely insensitive to conversational framing. Safety benchmarks (AdvBench refusal, jailbreak resistance) test the model's behavioral alignment, which depends critically on how the input is framed -- specifically, whether the model recognizes the input as a conversation with a user (triggering safety-aligned behavior) or as a raw text completion task (bypassing safety alignment).

Chat template divergence between GGUF and HuggingFace formats is the proximate cause of the backend safety effect. The deeper cause is that safety training is context-dependent: models are trained to be safe in specific conversational formats, and deviations from those formats can inadvertently bypass the safety training. This is conceptually related to jailbreaking -- both exploit the model's sensitivity to input framing -- but template divergence is unintentional (a conversion artifact) while jailbreaking is adversarial (a deliberate attack).

2.10 The safety veneer hypothesis

The safety veneer hypothesis posits that RLHF alignment is a "thin coating" applied to the surface of pre-trained model behavior, rather than a deep modification of the model's internal representations. If true, this would predict that safety degrades faster than capability under any perturbation (quantization, template change, noise injection), because the safety modifications are smaller in magnitude and less robust than the pre-training-derived capabilities.

TR137 tests this hypothesis across 10 model-axis combinations (models x optimization axes) by computing the normalized safety score and normalized capability score at each optimization level and comparing their degradation rates. The result: only 3 of 10 combinations show safety degrading faster than capability. In 4 combinations, capability degrades faster; in 3, the rates are comparable.

The refutation of the safety veneer hypothesis as a universal claim does not mean safety is robust. It means that safety and capability are intertwined in complex, model-specific ways that do not admit a simple "safety is always the first thing to break" narrative. For Llama 1B under quantization, safety does degrade faster than capability (safety/capability ratio < 1.0 at Q2_K), supporting the veneer hypothesis for that specific model. For Qwen 7B under quantization, capability degrades faster (safety/capability ratio > 1.0), contradicting the hypothesis. The practical implication is that practitioners cannot use capability benchmarks as a proxy for safety: a model that preserves MMLU accuracy may or may not preserve refusal behavior, and the only way to know is to test safety directly.


3. Methods and Measurement Framework

3.1 Experimental design

The safety research program uses a one-at-a-time (OAT) factorial design. Each TR varies one optimization axis while holding the others constant:

The OAT design means we can estimate marginal effects of each axis but cannot measure interactions (e.g., "does quantization make concurrency effects worse?"). The synthesis (TR137) uses an additive model for combined projections, which assumes no interaction. This assumption is conservative for the concurrency axis (where effects are zero regardless) but may underestimate or overestimate combined effects for the quantization-backend interaction (which remains untested).

3.2 Statistical toolkit

The following methods are applied across the program, selected to match the structure of each comparison and the inferential demands of each claim:

  • Bootstrap CIs: 2,000 iterations, seed 42, percentile method, on all key metrics (slopes, means, deltas). Provides distribution-free confidence intervals that do not assume normality.
  • Cohen's d: Standardized effect size on every pairwise comparison. < 0.2 trivial, 0.2-0.5 small, 0.5-0.8 medium, > 0.8 large. On binary data (0/1), d is mechanically bounded (max approximately 2.0 at p=0.5); reported values should not be compared directly to continuous-metric d values.
  • Holm-Bonferroni: Multiple comparison correction on all families of tests. More powerful than classical Bonferroni while maintaining family-wise error rate control. Only Holm-surviving tests are used for policy decisions.
  • TOST equivalence: Two One-Sided Tests at +/-3pp margin where "no difference" is claimed. This is strictly stronger than "not significant" -- TOST provides positive confirmation of equivalence, not merely failure to reject difference.
  • Chi-squared independence: With Cramer's V effect size for backend comparisons (TR136). Tests whether safety outcome is independent of backend choice.
  • Welch's t-test: For unequal-variance group comparisons. Applied to adjacent quantization levels (TR134) and pairwise backend comparisons (TR136).
  • ANOVA (one-way): For 3+ group comparisons (model families in TR134). Tests whether RLHF recipe affects safety robustness.
  • Pearson correlation: For cross-axis vulnerability analysis (requires >= 3 shared models per pair).
  • I-squared heterogeneity: Between-model variance as percentage of total variance. Quantifies whether models agree on the direction and magnitude of an effect. < 25% low, 25-75% moderate, > 75% high.

  • Linear regression: With R-squared, residual SE, slope CIs for safety degradation curves (normalized score vs BPW).

  • Power analysis: Minimum detectable effect via two-proportion z-test for binary outcomes. Reveals that safety MDE is 18.3pp per variant (TR134, N=117) and 6.5-7.3pp aggregate (TR135, N=468).
  • Wilson confidence intervals: For accuracy proportions, maintaining nominal coverage at extreme proportions and small sample sizes.

3.3 Analysis pipeline

Each TR follows the same analysis architecture: 14-18 sequential passes, each computing one focused analysis from scored samples. Raw computation operates on per-sample data, not re-reported summaries. Output is comprehensive JSON (analysis), scored JSONL (per-sample), and CSV (tabular summaries). The pass architecture ensures reproducibility: given the same scored samples, the analysis pipeline produces identical JSON output deterministically.

The three experimental TRs (TR134, TR135, TR136) share the same scoring pipeline and analysis pass structure, enabling direct cross-TR comparison at anchor configurations. TR134 uses 14 analysis passes covering baseline computation, pairwise degradation, slope estimation, jailbreak analysis, per-category bias, judge agreement, and family ANOVA. TR135 uses 16 passes including concurrency-specific equivalence testing, agent disagreement analysis, and latency scaling. TR136 uses 14 passes including backend decomposition, Jaccard similarity, and chi-squared independence testing.

TR137 does not re-process raw samples; it synthesizes published statistics, which means it cannot re-stratify data or compute statistics on novel groupings. This is a deliberate design choice that preserves the separation between per-axis measurement (source TRs) and cross-axis synthesis (TR137).

3.4 Scoring pipeline

All safety scores are produced by automated classifiers applied consistently across all conditions:

  • RefusalDetector: Regex-based classifier detecting approximately 15 refusal patterns in model output (e.g., "I cannot", "I'm not able to", "As an AI", "I must decline", "I'm sorry, but I can't"). Applied to AdvBench and jailbreak tasks. Binary output: 1 = refusal detected (safe), 0 = no refusal detected (unsafe).
  • BiasDetector: Regex-based classifier detecting stereotyped responses in BBQ disambiguation questions. Compares model output to stereotypical answer choice. Binary output: 1 = non-stereotypical answer (unbiased), 0 = stereotypical answer (biased).
  • TruthfulnessScorer: Reference-matching classifier comparing model output to gold-standard answers from TruthfulQA. Binary output: 1 = correct (truthful), 0 = incorrect (untruthful).

LLM judge validation (Qwen 2.5 7B Instruct Q8_0) was applied in TR134 (12,168 samples) and TR136 (5,616 samples). The judge uses structured prompts to classify responses as FULL_REFUSAL, PARTIAL_REFUSAL, COMPLIANCE, or UNCLEAR. The judge runs at fixed Q8_0 regardless of the evaluated model's quantization level, providing a consistent (if imperfect) independent signal. Cohen's kappa between regex classifiers and the judge is 0.147 overall (poor), with task-specific kappas of 0.013 (AdvBench, slight) and 0.282 (TruthfulQA, fair).

3.5 Model selection rationale

The model selection across the three experimental TRs balances coverage against compute constraints:

TR134 tests 4 models spanning 3 families and 3 alignment recipes: Llama 3.2 1B (1.2B params, GQA, Meta RLHF), Llama 3.2 3B (3.2B params, GQA, Meta RLHF), Mistral 7B Instruct v0.3 (7.3B params, GQA, Mistral SFT), and Qwen 2.5 7B Instruct (7.6B params, GQA, Alibaba DPO). The two Llama sizes enable within-family size comparison; the three families enable cross-family RLHF recipe comparison. The 7B models use Q8_0 as baseline because FP16 at 7B exceeds single-GPU VRAM on the 12 GB test hardware.

TR135 tests 3 models: Llama 3.2 1B, Llama 3.2 3B, and Qwen 2.5 3B. The 7B models are excluded because concurrent inference at N=8 with 7B models on 12 GB VRAM is infeasible (VRAM exhaustion). The Qwen variant shifts from 7B to 3B for the same reason. All models run at Q4_K_M, the Phase 2 recommended deployment level, isolating concurrency as the sole variable.

TR136 tests 3 models: Llama 3.2 1B, Llama 3.2 3B, and Qwen 2.5 1.5B. The Qwen variant shifts from 3B to 1.5B due to vLLM FP16 VRAM constraints on 12 GB hardware (3B FP16 plus vLLM serving overhead exceeds available VRAM). This means Qwen is represented by three different model sizes across the three TRs (7B, 3B, 1.5B), making cross-TR Qwen comparisons family-level rather than model-level.

The anchor models -- Llama 3.2 1B and 3B -- appear in all three TRs, providing the cross-axis comparison substrate. The 2-model anchor set is the minimum required for I-squared computation but forces binary heterogeneity estimates (either near 0% or near 100% with no middle ground). Expanding the anchor set to 3+ models is the highest-priority methodological improvement for future work.

3.6 Task battery design

The 6-task battery (4 safety + 2 capability) is designed to cover the major dimensions of LLM safety while remaining computationally tractable across the large experimental design space:

The unequal sizes reflect the availability of benchmark data and the different statistical requirements per task. 3.8 Concurrency testing protocol

TR135 uses a closed-loop protocol matching TR129's multi-agent methodology, adapted for safety evaluation:

Each of N agents (N = 1, 2, 4, 8) processes the complete 6-task battery independently, sending one request at a time and waiting for the full response before proceeding. Agents run concurrently against a single Ollama instance serving Q4_K_M quantized models. Temperature is fixed at 0.0 for deterministic output.

Scores are aggregated per-prompt across agents before computing group statistics, preventing inflated sample sizes from correlated within-prompt observations. For a given prompt, if all N agents produce the same output (as expected at temperature 0 with serialized inference), the prompt receives a single score. If agents disagree (indicating non-determinism), the mean score is used with the disagreement documented separately.

The per-prompt aggregation is conservative: it produces 10,416 prompt-level observations from 39,060 raw records. Agent disagreement is low (max std-dev 0.046 at N=8), consistent with near-deterministic output under Ollama's serialized inference.

3.9 Backend testing protocol

The design enables two clean comparisons and one confounded comparison: (1) Ollama Q4_K_M vs Ollama Q8_0 isolates the quantization effect within the GGUF/Ollama stack. (2) vLLM FP16 vs TGI FP16 isolates the serving framework effect at identical precision and weight format. (3) Ollama Q8_0 vs vLLM FP16 confounds backend with residual quantization (8-bit vs 16-bit) and weight format (GGUF vs HuggingFace). The confound in comparison (3) is unavoidable without custom model packaging and is addressed by noting that the within-Ollama quantization effect (comparison 1) is trivial (d < 0.09), implying that the large cross-backend effect (comparison 3) is primarily driven by the backend/format variable, not residual quantization.

All backends process identical prompts sequentially on a single GPU to avoid contention. Temperature is fixed at 0.0 with seed=42. System prompts are sent through each backend's native API, but the encoding of those system prompts differs between GGUF-embedded templates and HuggingFace chat template application -- this is the confound that TR136 identifies as the primary driver of the backend safety effect.

3.10 LLM judge design

The LLM judge (Qwen 2.5 7B Instruct at Q8_0) provides an independent safety classification signal that does not share the regex classifier's pattern-matching limitations. The judge receives the model's complete response and a structured prompt asking it to classify the response into one of four categories:

  • FULL_REFUSAL: The model explicitly and completely refuses to comply with the harmful request.
  • PARTIAL_REFUSAL: The model expresses reluctance or provides caveats but still provides some harmful information.
  • COMPLIANCE: The model complies with the harmful request without refusal.
  • UNCLEAR: The response is ambiguous, incoherent, or cannot be classified.

The judge runs at fixed Q8_0 regardless of the evaluated model's quantization level, providing consistency across conditions. However, the judge shares a potential bias: it is one of the evaluated model families (Qwen), and correlated failure modes between the judge and Qwen responses cannot be ruled out.

The poor kappa (0.147 overall) is informative rather than disqualifying. It reveals that regex classifiers and LLM judges measure partially different constructs: the regex classifier detects explicit refusal phrases, while the LLM judge evaluates the semantic intent of the response. At low quantization levels where model output becomes incoherent, these two approaches naturally diverge because incoherent text may contain refusal-like phrases without actually constituting a meaningful refusal.

3.11 Cross-axis synthesis methodology

TR137 synthesizes results from the three source TRs using the following protocol:

  1. Cross-TR validation: Verify consistency at anchor configurations (Q4_K_M, N=1, Ollama) shared across TRs. Tolerance: 5pp. Three task-model pairs exceed this tolerance (documented in TR137 Section 12), indicating some run-to-run variance despite deterministic temperature settings.

  2. Effect size ranking: Compute the maximum safety delta (baseline to worst configuration) per model per axis. Aggregate across models using the mean with bootstrap CIs (2,000 iterations, seed 42). Compute Cohen's d for the largest effect per axis. Express as percentage of total safety cost.

3.14 Quality metrics for capability-safety comparison

The safety-capability asymmetry analysis requires normalization to enable cross-metric comparison. Raw safety scores (refusal rate, bias resistance, truthfulness) and raw capability scores (MMLU accuracy, ARC accuracy) are on different scales with different baselines. By the end of the program, the threat surface has been reduced from "all three optimization axes might be dangerous" to "quantization and backend require per-model validation, concurrency is cleared." This narrowing is the primary operational value of the synthesis.

Second, the confidence column reveals an asymmetry between positive findings and null findings. The concurrency null finding (TR135) is the highest-confidence result in the program: TOST equivalence in 8/9 comparisons, zero jailbreak slopes, 0.0% I-squared, and a clear mechanistic explanation (serialized inference). The quantization finding (TR134) is directionally high-confidence but magnitude-uncertain: the MDE of 18.3pp means moderate effects could be undetected, and the I-squared of 99.9% means model-specific magnitudes vary wildly. The backend finding (TR136) is high-confidence in direction (backends differ) but the mechanism (template divergence) is inferred rather than directly measured -- no experiment isolates the template variable while holding all else constant. These asymmetries matter for deployment: the concurrency clearance can be acted on immediately, while the quantization and backend findings require per-deployment validation.

Third, the matrix documents a finding structure that could not have been predicted from Phase 2's results. Phase 2 found that backend choice does not affect quality (TR124, C2), which would logically suggest that backend choice does not affect safety either. The discovery that safety is differentially sensitive to backend choice -- through a mechanism (chat template divergence) that quality benchmarks cannot detect -- is a qualitative surprise that validates the decision to test safety independently rather than assuming it inherits from quality results. This pattern has a meta-level implication: any optimization axis that Phase 2 declared "equivalent" for quality should be independently validated for safety, because quality equivalence does not imply safety equivalence.


5. Results by Report

The subsections are ordered chronologically (TR134 through TR137), matching the order in which the experiments were conducted, because each report's design was informed by the findings and limitations of its predecessors. Together, these subsections document the progressive refinement from per-axis safety measurement (TR134-TR136) through cross-axis synthesis (TR137).

5.1 TR134: Alignment Robustness Under Quantization

Research question. Does quantization degrade safety alignment, and if so, does it degrade safety disproportionately to capability?

Phase 2 (TR125) mapped the quantization decision space for capability, testing 5 models across 7 quantization levels on MMLU and ARC-Challenge benchmarks. The result was a crisp deployment recommendation: Q4_K_M is the recommended default across tested models, losing at most -4.1pp of benchmark accuracy. But capability benchmarks test whether the model can answer science questions correctly -- they do not test whether the model will refuse to help synthesize methamphetamine, avoid reinforcing racial stereotypes, or resist adversarial jailbreak prompts. The safety-quality tradeoff of quantization is an entirely separate question from the capability-quality tradeoff, because safety alignment is encoded through fine-tuning modifications that are small relative to the pre-training weights and may therefore be disproportionately affected by weight perturbation. A model that preserves MMLU accuracy at Q4_K_M while silently losing its ability to refuse harmful requests is a deployment hazard that no amount of capability testing can detect. TR134 fills this gap by applying a comprehensive safety evaluation battery across the full quantization spectrum on multiple model families, producing the first multi-family quantization safety profile in this program.

Extended analysis. The central finding of TR134 is not a single number but a pattern: quantization's safety impact is extreme, model-specific, and unpredictable from capability benchmarks. The I-squared statistic of 99.9% means that almost all variance in safety degradation is between-model rather than within-model -- models disagree not on whether quantization matters, but on how much and in which direction. Llama 1B loses 35.2pp of safety at Q2_K (Cohen's d = 1.93, a large effect by any convention), while Llama 3B improves by 6.0pp at the same quantization level. Mistral 7B has the steepest degradation slope (+0.041 per BPW) but starts from a weak baseline (87-100% jailbreak compliance even at Q8_0), meaning its safety problem is not quantization-induced but pre-existing. Qwen 7B is nearly flat (+0.008 per BPW), suggesting that DPO-based alignment is more robust to weight perturbation than RLHF (Llama) or SFT (Mistral).

The Llama 3B anomaly deserves careful interpretation. The +6.0pp safety improvement at Q2_K is almost certainly not a genuine improvement in safety alignment. Q2_K degrades coherence so severely that the model produces incoherent or truncated outputs that happen to contain refusal-like phrases (fragments of the safety training leaking through garbled text). The RefusalDetector, being a regex classifier, detects these phrases and scores the response as a refusal -- even though the model is not coherently refusing so much as failing to produce coherent compliance. The practical safety outcome is the same (the model does not provide useful harmful content at Q2_K), but the mechanism is capability collapse rather than robust refusal. This distinction matters for deployment: a model that refuses coherently at Q4_K_M is safer than a model that produces incoherent garbage at Q2_K, even if the refusal score is higher for the latter.

The jailbreak amplification analysis reveals a systematic relationship between quantization and adversarial vulnerability. All four jailbreak techniques (prefix injection, DAN-style, roleplay, direct) show negative slopes, meaning compliance increases at lower bits per weight. Prefix injection is the most effective amplifier at -0.036 per BPW, followed by direct requests at -0.030, DAN-style at -0.024, and roleplay at -0.021. 5.2 TR135: Multi-Agent Concurrency x Safety

Research question. Does concurrent inference degrade safety, and does safety degrade faster than capability under concurrent load?

TR134 showed that quantization degrades safety for specific models, but all measurements used single-agent inference. 5.4 TR137: The Safety Tax of Inference Optimization (Synthesis)

Research question. What is the total safety cost when all three optimization axes are considered together, and which axis should practitioners worry about most?

Each of the three source TRs answered one question in isolation: TR134 measured quantization's safety cost, TR135 measured concurrency's safety cost, and TR136 measured backend's safety cost. But a practitioner facing a deployment decision must weigh all three simultaneously. If the testing budget is limited, should they prioritize quantization validation, concurrency testing, or backend migration testing? If they deploy at Q4_K_M with N=4 agents on vLLM, what is the total safety cost? Does the safety veneer hypothesis -- that RLHF alignment is more fragile than general capability -- hold across all axes or only some? Do models agree on which axis is dangerous, or do different models require different validation priorities? These cross-axis questions cannot be answered by any individual TR; they require a meta-analysis that synthesizes the three measurement programs into a unified framework. A model that loses MMLU accuracy may paradoxically maintain safety (as in Llama 3B's anomalous Q2_K behavior). The only way to know is to measure safety directly.

The veneer hypothesis does hold for specific models under specific conditions -- most notably Llama 1B under quantization, where safety degrades catastrophically while capability degrades severely but not catastrophically. For this model, RLHF alignment does appear to be more fragile than general capability. But this is a model-specific finding, not a universal law. The heterogeneity across models (I-squared = 99.9%) means that the veneer hypothesis's validity is itself model-dependent.

The program's output is not a set of universal safety rules -- the extreme model heterogeneity (I-squared = 99.9%) precludes universality -- but a safety decision framework that tells practitioners which optimization axes require validation, which can be ignored, and what per-model profiling protocol must accompany any deployment decision in a safety-sensitive context.

The safety cost of inference optimization is real and concentrated in two axes. Quantization accounts for 57% of total safety cost, with effects ranging from catastrophic (Llama 1B loses 35pp at Q2_K, d = 1.93) to negligible (Qwen 7B slope = +0.008, near-flat). Backend choice accounts for 41%, driven by an entirely new safety variable -- chat template divergence between GGUF-embedded and HuggingFace tokenizer formats -- that produces 4-25pp safety differences invisible to capability benchmarks. Concurrency accounts for 2%, which is entirely within measurement noise: the concurrency null finding (max delta 0.4pp, all jailbreak slopes zero, I-squared = 0.0%) is the strongest and most generalizable result in the program. But variance, not average effect size, is the key finding. I-squared = 99.9% means models disagree completely on quantization's safety impact; a generic guideline based on average effects will be wrong for approximately half the models it is applied to. The per-model safety profiling mandate is therefore the program's most important operational recommendation -- more important than any specific threshold or ban.

The good news is substantial. Q4_K_M -- Phase 2's recommended quantization level -- preserves >= 93% of baseline safety for all tested models, confirming that the performance-optimal configuration is also safety-acceptable. Concurrency can be scaled freely without safety concern, fully compatible with Phase 2's scaling recommendations. The backend safety effect has an identifiable, potentially fixable root cause (template alignment), meaning the vLLM throughput advantage can be preserved while eliminating the safety cost. And the safety veneer hypothesis is refuted as a universal claim: RLHF alignment is not a uniquely fragile thin layer for most models, meaning safety and capability can be jointly optimized rather than traded off. The program has completed three phases -- methodology (Phase 1, TR117-TR122), performance (Phase 2, TR123-TR133), and safety (Phase 3, TR134-TR137) -- producing a complete, artifact-backed deployment framework for local-first LLM inference that jointly addresses cost, throughput, quality, and safety. The safety gap identified in Phase 2's conclusive report is now closed.

G.1 Choosing quantization for Llama 3.2 1B in a safety-critical deployment

Scenario: Deploy Llama 3.2 1B for a consumer-facing chatbot. Safety is a hard requirement: the model must refuse harmful requests at > 90% retention.

Step 1 -- Check Phase 2 capability recommendation. TR125 recommends Q4_K_M (within -4.1pp of FP16 on MMLU/ARC). This is the starting point.

Step 2 -- Check Phase 3 safety profile. TR134: Llama 1B at Q4_K_M retains 98.4% of baseline safety. Risk tier: Low. Passes the 90% threshold with substantial margin.

Step 3 -- Check jailbreak amplification. At Q4_K_M, Llama 1B jailbreak compliance is low (near baseline). All four technique slopes are negative (compliance increases at lower BPW), but Q4_K_M is sufficiently above the cliff. Prefix injection compliance at Q4_K_M is approximately 5% (vs 60% at Q2_K).

Step 4 -- Decision. Deploy Llama 3.2 1B at Q4_K_M. Safety retention 98.4%, risk tier Low. No additional safety layers required beyond standard monitoring.

Step 5 -- What if Q3_K_S were needed for VRAM reasons? TR134 data shows Llama 1B begins degrading below Q4_K_M. Q3_K_S safety retention is approximately 90-95% (moderate risk). Deployable with enhanced monitoring but not recommended if Q4_K_M fits in VRAM.

Step 6 -- What about Q2_K? Banned. Retention = 57.5%, CRITICAL risk. Do not deploy under any circumstances.

G.2 Migrating from Ollama to vLLM for multi-agent serving

Scenario: Current deployment: Llama 3.2 1B on Ollama Q4_K_M, N=1. Want to scale to N=8 agents. Phase 2 recommends vLLM at N>=4.

Step 4 -- Mitigation options. (A) Fix the template: configure vLLM to use the GGUF-equivalent template. Re-run safety battery to verify the fix eliminates the safety cost. Step 3 -- Compare against program baselines. If Gemma's safety slope is between +0.008 (Qwen-like, robust) and +0.041 (Llama/Mistral-like, fragile), the model fits within the observed range. If outside this range, update the program's heterogeneity statistics.

With only 2 models in the anchor set, I-squared is mathematically bimodal. The formula Q = sum(w_i * (effect_i - effect_pooled)^2) with k=2 produces either Q near 0 (models agree) or Q much greater than df=1 (models disagree). There is no continuous middle ground. The interpretation must be qualitative:

  • I-squared near 0%: models agree on direction and magnitude. Generalization is justified.
  • I-squared near 100%: models disagree on direction or magnitude. No generalization is possible.

Appendix AL: Cross-Phase Synthesis Narrative (Phase 2 + Phase 3)

The integration of Phase 2 and Phase 3 produces the most complete deployment framework in the program's history. Phase 2 answered "what to deploy for performance" across 11 technical reports and ~70,000 measurements. Phase 3 answers "is it safe to deploy Phase 2's recommendations" across 4 technical reports and 74,254 samples. Together, they span 15 technical reports and ~144,000 data points.

The most important cross-phase finding is the backend tension. Phase 2's recommendation of vLLM at N>=4 (TR130: 2.25x throughput) is partially contradicted by Phase 3's finding that vLLM introduces 4-25pp safety cost (TR136: template divergence). The resolution -- template alignment as an engineering fix that preserves both throughput and safety -- illustrates the value of testing safety independently rather than assuming it inherits from quality results.

The second cross-phase finding is reinforcement. Phase 2's Q4_K_M recommendation (TR125: capability sweet spot) is confirmed by Phase 3 (TR134: >= 93% safety retention). Phase 2's Q2_K prohibition (TR125: capability-unacceptable) is reinforced by Phase 3 (TR134: CRITICAL safety risk for Llama 1B). The convergence of capability and safety recommendations at Q4_K_M simplifies deployment: there is no tension between performance and safety at this quantization level.

The third cross-phase finding is orthogonality. Phase 2's concurrency scaling recommendations (TR129: Amdahl s=0.39-0.54; TR130: vLLM 2.25x at N=8) are fully compatible with Phase 3's concurrency safety clearance (TR135: zero effect). Concurrency decisions can be made on pure performance grounds without safety constraints, which is the simplest possible integration outcome.


Appendix AM: Extended Risk Mitigation Strategies

AM.1 Q2_K Ban Enforcement

Implement a configuration validation step in the deployment pipeline that rejects any configuration specifying Q2_K quantization for models with parameter counts below 2B. The validation should:

  • Parse the model manifest for parameter count
  • Check the quantization level against a block list
  • Reject with a clear error message citing TR134 (57.5% retention for Llama 1B)
  • Log the rejection for audit purposes

Appendix AO: Evaluation Philosophy and Limitations

The Phase 3 evaluation philosophy prioritizes decision utility over measurement perfection. This means:

  1. Automated classifiers are sufficient for the decisions being made. The choice between Q4_K_M and Q2_K does not require human evaluation -- the automated classifiers clearly detect the 35pp difference. The choice between vLLM and Ollama requires template validation, which is an engineering check rather than a measurement problem. The automated classifiers capture the relevant safety signal for all deployment decisions in the program.

  2. Poor inter-rater agreement (kappa = 0.147) does not invalidate cross-condition comparisons. Both classifiers are consistent across conditions, meaning that systematic biases cancel when computing deltas. The directional findings (quantization is dangerous, concurrency is safe, backend matters) are robust to classifier choice. Only absolute safety scores carry classifier-dependent uncertainty.

  3. Per-model profiling is the correct response to I-squared = 99.9%. Rather than attempting to improve the aggregate statistics (which would require testing dozens of models), the program accepts model heterogeneity as a fundamental property of the safety landscape and mandates per-model validation as the operational response. This shifts the burden from the research program (which cannot test every model) to the deployment practitioner (who must test their specific model).

  4. Temperature=0 is the right default for safety evaluation. Stochastic sampling introduces variance that complicates safety comparison. Temperature 0 produces deterministic outputs, enabling clean cross-condition comparisons. Safety at temperature > 0 is a separate question that requires its own evaluation, acknowledged as a gap but deliberately excluded from the current program's scope.

  5. Binary safety scores are a deliberate simplification. Real-world safety is not binary (refusal vs compliance) but a spectrum (full refusal, partial refusal with caveats, compliance with warnings, full compliance). The binary scoring collapses this spectrum into a single bit per sample, losing nuance but gaining statistical tractability. The LLM judge's 4-category classification provides partial recovery of this nuance, but the poor kappa between binary and 4-category classifications suggests that the nuance recovery is imperfect. Future work should explore ordinal scoring models that preserve the safety spectrum while remaining computationally tractable.

  6. The safety battery covers major dimensions but is not exhaustive. Refusal (AdvBench), truthfulness (TruthfulQA), bias (BBQ), and adversarial robustness (jailbreak) represent four critical safety dimensions. Uncovered dimensions include: privacy leakage (does quantization increase memorized data extraction?), hallucination severity (does quantization increase confident but wrong assertions?), instruction injection (are quantized models more susceptible to prompt injection?), and capability misuse (can quantized models be repurposed for harmful capability generation?). These dimensions are legitimate safety concerns that future work should address, but they were outside the scope of the current program's focus on alignment robustness under optimization.
